Complete the released conditional Kumo-Anomaly inference port in SDM, consolidating the denoiser and DPM components with checkpoint loading, preprocessing, reconstruction, and anomaly scoring.

  • Expose KumoAnomaly for ordered numerical Tensor/TableTensor inputs, with optional reference-only preprocessing and explicit random-generator control.
  • Load the pinned nvidia/Kumo-Anomaly checkpoint using its embedded architecture configuration and strict parameter mapping.
  • Run second-order single-step DPM-Solver++ with a corrected direct timestep mapping, complementary temporal masks, and median reconstruction.
  • Return MAE/L2 anomaly scores and reconstructions in preprocessed model space, exclude padded features from scoring, and retain partial final windows using repeat-last padding.
  • Add the feature preprocessing recipe, public exports, API documentation, and an inference example.

Ported from Kumo-TS at af74798. Existing Apache-2.0 and DPM-Solver MIT notices are retained; no dependencies or license files are added.

Scope is pretrained conditional inference. Training, unconditional checkpoints, DDPM/DDIM sampling, and dataset-specific preprocessing/reporting are not included. Reconstruction is not causal. The corrected timestep mapping can change predictions; SDK score and threshold equivalence are not claimed.

Real-checkpoint CPU smoke tests and numerical comparisons against the timestep-corrected upstream implementation passed on PyTorch 2.7 and 2.14. GPU accuracy and performance remain unvalidated.

📝 Summary

Summary by CodeRabbit

  • New Features
    • Added an example showing how to score a time series with injected anomalies and interpret the resulting reconstruction-error scores.
  • Bug Fixes
    • Anomaly scoring now limits extreme reconstruction values and scores, helping prevent excessively large results.

_KumoAnomaly.forward bounds values before calculating reconstruction-error scores. A new example creates a synthetic series with an injected anomaly and prints its scores.

Changes: Kumo-Anomaly

Layer / File(s) Summary
Bounded scoring and example
sdm/models/kumo/timeseries/anomaly/model.py, examples/kumo_anomaly.py
_KumoAnomaly.forward clamps reconstructions and targets to [-1e8, 1e8] before computing mean absolute error, then caps scores at 1e8. The example scores a synthetic two-feature series with an injected anomaly.

Put AnomalyOutput before KumoAnomaly so the exports follow dependency order.

KumoAnomaly.forward returns AnomalyOutput, so KumoAnomaly depends on it. The import and __all__ list KumoAnomaly first, which reverses that order. Reorder both lines to match.

Validate percentile_filter in both constructors.

percentile_filter is expressed as a percentage, so 95 is valid and maps to quantile 0.95. However, values outside [0, 100] pass construction and can fail on the first non-empty forward call when scores.quantile() receives a value outside [0, 1]. Add constructor checks in both classes.

Proposed fix
         if min_segment_size < 1:
             raise ValueError("'min_segment_size' must be positive")
+        if not 0 <= percentile_filter <= 100:
+            raise ValueError("'percentile_filter' must be in [0, 100]")

Apply the same check in MACSThreshold.__init__.

# Summary

> Adds `DPMSolver`, the sampler Kumo-Anomaly uses to reconstruct windows
from noise. It is the second-order, single-step DPM-Solver++ on a
uniform time grid, built on the existing `NoiseScheduleVP`.

# Description of the change

> `DPMSolver(betas, num_steps=20)` computes the time grid, the solver
coefficients and the denoiser step indices once, and stores them as
non-persistent buffers. `forward(x, predict_noise)` then runs the
updates with a noise-predicting callable. Odd step counts end with a
first-order update. There is no final denoising or clipping, and no
host-device synchronization.
>
> Each solver time `t` maps to the training step index `round(t *
total_N - 1)`, the integer step the denoiser is trained on. With the
default 500-step schedule and 20 steps, the denoiser sees steps 499,
474, ..., 25.
>
> The implementation comes from Aditi Gautam's `sampling.py` in #1167,
which adds the rest of Kumo-Anomaly in one PR. This is the first of the
PRs that split #1167 into reviewable pieces, following #1083.

# Validation

> With the same step mapping, outputs are bitwise identical to the
reference DPM-Solver++ implementation (single-step, order 2, uniform
time) for 1, 2, 3 and 20 steps in float32 and float64.

# Summary

> Implements `KumoAnomaly.forward` and the `_KumoAnomaly` core for the
contract from #1220, so the model scores each time step of a
multivariate series by its reconstruction error. Weights are randomly
initialized here; loading the checkpoint follows later in this stack.

# Description of the change

> `model(x, *, recipe=None, num_samples=30, num_steps=20,
callbacks=None, generator=None)` fits the recipe from #1221 on `x`
(shape `[..., R, D]`, with rows as ordered time steps) and returns
scores with shape `[..., R, 1]`. Callbacks follow `ICLModel`:
`on_query_preprocessing_end` runs after pre-processing and
`on_model_forward_end` after the forward pass, and gradients are enabled
when training or when a callback requires them. Unsupported feature
stypes trigger the same warning as in `ICLModel`, and more than 40
features after pre-processing raise.
>
> Rows are split into windows of 100 time steps, and the final partial
window is padded by repeating its last row. Each window is normalized by
its scalar mean and standard deviation, and four alternating blocks are
reconstructed under two complementary masks with the DPM-Solver++
sampler from #1190. The lower median over `num_samples` draws per mask
gives the reconstruction, and the score is the mean absolute
reconstruction error across features.
>
> The implementation comes from Aditi Gautam's `model.py` in #1167,
adapted to the `Model` contract from #1220. This PR is stacked on #1190.

# Summary

> Loads the released Kumo-Anomaly weights in `KumoAnomaly()`, filling in
the checkpoint TODO from #1220.

# Description of the change

> `_load_from_pretrained` loads `final_model.pth` from
`nvidia/Kumo-Anomaly` at the pinned revision, and `remap_ckpt` maps the
checkpoint's state dict onto the SDM modules for a strict load. Inside
each time and feature layer, the attention, feedforward and
residual-norm weights are renamed to `attn.qkv_lin`, `attn.out_lin`,
`mlp.0`/`mlp.3` and `attn_residual_norm`/`mlp_residual_norm`. The three
kernel-size-1 `Conv1d` projection weights are squeezed for the `Linear`
layers.
>
> The model is built on the target device rather than on `meta`. The
step embedding's sinusoidal lookup is a non-persistent buffer that the
checkpoint does not contain, so `load_state_dict(..., assign=True)`
would leave it on `meta`.
>
> The loader and key mapping come from Aditi Gautam's `ckpt.py` in
#1167. This PR is stacked on #1106.

# Validation

> CI does not download the weights, so these checks were run manually on
CPU:
>
> - All 260 checkpoint tensors load strictly.
> - Compared with #1167's pretrained `KumoAnomaly` (`num_samples=3`,
`num_steps=5`, seeded generator), scores for series of shape `[250, 5]`
and `[130, 30]` differ by at most 7.2e-7 and 1.5e-7, with identical
top-10 rows. Swapping `norm1` and `norm2` in the remap changes scores by
up to 0.52, so this comparison catches same-shape remap mistakes.
> - On a 400-step series with a level shift at steps 250-259, the
default call ranks exactly those steps highest.

Compute float16 scores in float32.

KumoAnomaly inherits torch.nn.Module, so callers can convert the model and input to float16. The preprocessing path preserves that dtype. In float16, 1e8 is not a finite representable bound, and the subtraction can overflow to inf before clamp_max runs.

Convert both tensors before clamping and subtraction:

Suggested fix
         out = out.view(x.size())[:, :R, :D]
+        target = x[:, :R, :D]
+        if out.dtype == torch.float16:
+            out = out.float()
+            target = target.float()
         # Bound model-space values before scoring, matching upstream.
         out = out.clamp(-1e8, 1e8)
-        target = x[:, :R, :D].clamp(-1e8, 1e8)
+        target = target.clamp(-1e8, 1e8)
         out = (out - target).abs().mean(dim=-1).clamp_max(1e8)
